Serving Tools: From Simple to Supercharged

2 min read

The DIY Approach: FastAPI

For simple use cases, small teams, or early-stage products, FastAPI is an excellent starting point. It is a modern Python web framework that lets you define an API endpoint in roughly 20 lines of code. You load your model once at startup, define a request schema using Pydantic, and return predictions. FastAPI handles HTTP parsing, JSON serialization, and auto-generates interactive API documentation.

This approach works well until traffic grows. A single FastAPI worker process handles one request at a time. Under load, requests queue up, and latency spikes.

The Heavy Lifters: TorchServe and Triton Inference Server

Specialized model serving systems are built from the ground up to solve the problems that emerge at scale.

TorchServe is the official PyTorch model server. It handles model packaging, versioning, and multi-worker request handling natively. You package your model into a .mar (Model ARchive) file and deploy it to TorchServe, which manages the lifecycle.

NVIDIA Triton Inference Server is framework-agnostic — it can serve PyTorch, TensorFlow, ONNX, and TensorRT models from the same server. It is the industry standard for GPU-accelerated inference at scale. Key capabilities include:

  • Dynamic Batching: Triton holds incoming requests in a queue for a configurable window (e.g., 5 milliseconds). It then groups them into a single batch and sends the batch to the GPU in one operation. A GPU processing a batch of 32 inputs is far more efficient than processing 32 individual inputs sequentially, because GPUs are designed for massively parallel computation. This can increase throughput by 10–50× compared to sequential processing.
  • Concurrent Model Execution: Multiple model instances can run simultaneously on the same GPU, keeping the hardware fully utilized.
  • Multi-Model Serving: Dozens of models can be loaded and managed on a single server, with Triton handling memory allocation and eviction.
  • Built-in Health and Metrics Endpoints: Triton exposes /v2/health/ready and Prometheus-compatible metrics out of the box, making it easy to integrate with monitoring systems.
